I think I've narrowed this down to a regression between cups 1.3.9-2 and cups 1.3.9-2ubuntu1. On a fresh install this works as expected. After applying the cups 1.3.9-2ubuntu1 update it's broken. Downgrading cups makes it work again. Also it's not specific to any printer, it's reproducible with
