Ok. Found the fix. ~/.xpdfrc needs to contain:
displayFontT1 Times-Roman
/usr/local/share/ghostscript/8.60/lib/fonts/n021003l.pfb
displayFontT1 Times-Italic
/usr/local/share/ghostscript/8.60/lib/fonts/n021023l.pfb
Which is "displayFontT1" <name of font> /path/to/ghostscript/font/of/same/name
